Abstract
Systematická neshoda mezi simulovanými a reálnými daty, známá jako Sim-to-Real Gap, omezuje využití Monte Carlo simulací pro trénování modelů strojového učení. Tato práce se zabývá překlenutím této mezery pomocí generativních modelů pro data alfa částic a protonů z detektoru Timepix3, přičemž simulovaná data jsou generována v Allpix Squared. Pro převod ze simulovaných dat (Allpix Squared) na reálná měření jsou porovnávány dvě metody: deterministický model CUT a pravděpodobnostní difuzní model CDDPM, oba podmíněné fyzikálními podmínkami částic (zejména kinetickou energií a u protonů také úhlem dopadu). Vyhodnocení na rozsáhlých datasetech ukazuje, že pro protony dosahuje model CDDPM výrazně lepších výsledků, neboť přesněji reprodukuje distribuce klíčových parametrů i jejich korelace. U alfa částic, kde je nesoulad mezi simulací a experimentem výraznější, prokazuje model CUT robustnější generalizaci na dříve neviděných energiích alfa částic. Práce demonstruje, že generativní modely jsou efektivní cestou k tvorbě věrných syntetických dat pro částicovou fyziku.
The systemic discrepancy between simulated and real data, known as the "Sim-to-Real Gap," limits the use of Monte Carlo simulations for training machine learning models. This thesis addresses this gap using generative models for alpha particle and proton data measured with a Timepix3 detector, with simulated samples generated in Allpix Squared. To translate simulated data (Allpix Squared) to real measurements, two methods are compared: a deterministic CUT model and a probabilistic CDDPM diffusion model, both conditioned on the particles' physical conditions (in particular kinetic energy, and for protons also the incidence angle). Evaluation on extensive datasets shows that for protons, the CDDPM model achieves markedly superior results, accurately reproducing both key parameter distributions and their correlations. For alpha particles, where the simulation--experiment mismatch is more pronounced, the CUT model demonstrates more robust generalization to previously unseen alpha-particle energies. This work confirms that generative models provide an effective pathway for creating high-fidelity synthetic data for particle physics.
